OVERVIEW

About Evaluate Machine Learning Models Without Data Leakage

Evaluation estimates how a model may perform on data it has not seen. The estimate is only meaningful when the split, metric, and data preparation match the intended use.

LEARNING OUTCOMES

What You Will Learn

  • Choose suitable regression or classification metrics.
  • Explain why preprocessing belongs inside the training workflow.
  • Recognize leakage, overfitting, and distribution shift.
TOPIC GUIDE

Learn Evaluate Machine Learning Models Without Data Leakage

Match the metric to the decision

Mean absolute error and root mean squared error summarize different aspects of regression error. Precision, recall, and confusion matrices help describe classification behavior. Choose measures based on the cost and meaning of errors, not because a metric is familiar.

Keep evaluation data separate

Do not use the test set to repeatedly choose features or tune parameters. Repeatedly optimizing against it makes it part of the modeling process and weakens its role as a final check.

Prevent leakage

Leakage occurs when information unavailable at prediction time influences training or evaluation. It can enter through future fields, duplicate records across splits, or preprocessing fitted on all data. Fit transformations on training data within a pipeline, then apply them to held-out data.

Report limits

Include the split method, sample size, metric definition, and important data limitations. A good score on one sample does not guarantee performance after populations, processes, or time periods change.

PRACTICAL EXAMPLE

Example / Code

Example
from sklearn.pipeline import make_pipeline
from sklearn.impute import SimpleImputer
from sklearn.preprocessing import StandardScaler
from sklearn.linear_model import LogisticRegression

model = make_pipeline(
    SimpleImputer(),
    StandardScaler(),
    LogisticRegression(max_iter=1000)
)
model.fit(X_train, y_train)
print(model.score(X_test, y_test))
TRY IT YOURSELF

Practice Task

Apply what you learned with a practical activity.

Review a fictional model evaluation report. Identify the target, split, metric, and sample size. Find one possible leakage path and rewrite the conclusion to include an appropriate limitation.
